1. What is Reinforcement Learning?

Key Concepts:
- Agent: The learner or decision maker.
- Environment: The external system with which the agent interacts.

- State: The current situation or context in which the agent finds itself.
- Reward: Feedback from the environment based on the action taken by the agent.
Example: Consider a robot learning to navigate a maze. The robot (agent) receives feedback (reward) based on how close it gets to the goal (environment). The robot learns over time which actions lead to the goal efficiently.
2. Components of Reinforcement Learning
a. Environment and State Space:
- The environment is modeled as a state space where each state represents a possible configuration or situation of the environment.
- Example: In a chess game, each possible arrangement of pieces on the board represents a state.
b. Actions and Action Space:
- Actions are the choices available to the agent at any given state.
- Example: In a chess game, possible actions might be moving a pawn, knight, etc.
c. Rewards and Reward Function:
- Rewards provide feedback to the agent about the action taken. The reward function defines the goal of the learning process.
- Example: In a maze, the reward function might give +10 points for reaching the goal and -1 point for each step taken.
d. Policy:
- A policy is a strategy used by the agent to determine the next action based on the current state.
- Example: The robot might follow a policy of moving towards the goal whenever possible.
e. Value Function:
- The value function estimates the expected reward for a given state or state-action pair, guiding the agent's decision-making process.
f. Q-Function:
- The Q-function or action-value function evaluates the quality of a given action in a given state.
3. Key RL Algorithms
a. Model-Free vs. Model-Based RL:
- Model-Free: Learns directly from interaction with the environment without a model of the environment.
- Model-Based: Uses a model of the environment to make decisions.
b. Value-Based Methods:
- Q-Learning: An off-policy algorithm that learns the value of actions in states.
- SARSA (State-Action-Reward-State-Action): An on-policy algorithm that updates the Q-values based on the action taken by the agent.
c. Policy-Based Methods:
- REINFORCE: A Monte Carlo-based method for optimizing policy directly.
d. Actor-Critic Methods:
- Combines value-based and policy-based methods by using two models: an actor (policy) and a critic (value function).
